Customer segmentation is one of the most valuable applications of Machine Learning in retail analytics. Understanding customer purchasing behaviour enables businesses to create personalized marketing campaigns, improve customer retention, and increase profitability.
This project presents an end-to-end Retail Store Customer Clustering workflow using Python and K-Means Clustering. The notebook covers the complete machine learning pipelineβfrom raw data preprocessing to business-driven customer segmentation and strategic recommendations.
The objective is not only to build a clustering model but also to translate machine learning results into meaningful business insights that support data-driven decision-making.
Retail businesses often serve thousands of customers with different purchasing habits, income levels, and demographic characteristics. Applying the same marketing strategy to every customer is inefficient and reduces campaign effectiveness.
This project addresses that challenge by segmenting customers into meaningful groups based on their demographic information and purchasing behaviour, enabling businesses to:
- Understand customer characteristics
- Identify high-value customers
- Improve targeted marketing campaigns
- Increase customer retention
- Support business decision-making using data
Dataset: Marketing Campaign Dataset
The dataset contains customer demographic information, purchasing behaviour, campaign responses, and spending across multiple product categories.
- Customer Demographics
- Income
- Education
- Marital Status
- Number of Children
- Product Spending
- Purchase Behaviour
- Campaign Responses
- Customer Recency

The project includes extensive exploratory data analysis to understand customer characteristics before model development.
Performed analysis includes:
- Missing Value Analysis
- Duplicate Record Analysis
- Income Distribution
- Spending Behaviour
- Purchase Frequency
- Customer Age Distribution
- Correlation Analysis
- Feature Relationships
- Business Observations
Several new business-focused features were created to improve clustering performance.
Examples include:
- Customer Age
- Total Spending
- Total Purchases
- Total Children
- Customer Tenure
These engineered features provide better customer representation compared to using the raw dataset alone.
The customer segmentation workflow follows these steps:
- Data Preprocessing
- Feature Selection
- Standardization using StandardScaler
- Optimal Cluster Selection
- Elbow Method
- Silhouette Score
- K-Means Clustering
- Principal Component Analysis (PCA)
- Cluster Interpretation
- Business Recommendation Generation
The optimal number of customer clusters was determined using:
- Elbow Method
- Silhouette Score
These evaluation techniques ensure that customer segmentation is statistically meaningful and business-friendly.
The clustering model successfully identified three distinct customer segments.
| Customer Segment | Characteristics |
|---|---|
| Budget-Conscious Customers | Lower income, lower spending, fewer purchases |
| Regular Value Customers | Moderate income, consistent purchasing behaviour |
| Premium High-Value Customers | High income, highest spending, loyal customers |
Based on customer segmentation, the following business strategies were proposed:
- Promotional Discounts
- Cashback Offers
- Price-Sensitive Campaigns
- Loyalty Programs
- Personalized Promotions
- Seasonal Marketing Campaigns
- VIP Membership Programs
- Exclusive Product Launches
- Premium Rewards
- Early Access Campaigns
